A sequence-model audit shows how an apparently large architectural improvement can come from information the model should not have had. The researchers investigate an adaptive residual-routing decoder whose attention mask was causal, while another path still exposed earlier positions to future tokens.
The suspicious gain appeared during teacher-forced evaluation
The paper reports a 24-layer checkpoint with validation loss dropping from a baseline of 3.5958 to 1.4259. However, the checkpoint failed a prefix-invariance audit and produced worse free-running generation under a reference-model perplexity measure.
Prefix invariance asks whether outputs for an existing prefix change when later tokens are changed. A violation can reveal future information reaching a position that should depend only on its past. That is a different question from whether the attention mask itself has the intended shape.
The leakage came through routing
Layer diagnostics and implementation inspection trace the problem to a full-sequence summary broadcast through the dynamic routing-query path. The causal attention mask did not protect that separate information route.
The authors then train two independent 12-layer causal repairs. Both remove detectable leakage and return validation loss and reference perplexity to the control scale, eliminating the large apparent advantage. These repairs provide evidence about the diagnosed implementation failure, rather than proving that every adaptive routing design has the same defect.
Evaluate the whole model’s information paths
Supporting experiments include synthetic implementation pairs, clean pretrained controls, injected faults and cache checks across numerical precisions. The paper combines layer-level diagnostics with behavioral measures instead of relying on one aggregate loss.
For model developers, the practical lesson is to test what information can affect a prefix across the complete architecture. Teacher-forced loss should be read alongside causal checks and free-running behavior. A dramatic improvement deserves investigation when the model cannot reproduce that advantage under the conditions in which it will actually generate.
